Creative processes such as painting often involve creating different components of an image one by one. Can we build a computational model to perform this task? Prior works often fail by making global changes to the image, inserting objects in unrealistic spatial locations, and generating inaccurate lighting details. We observe that while state-of-the-art models perform poorly on object insertion, they can remove objects and erase the background in natural images very well. Inverting the direction of object removal, we obtain high-quality data for learning to insert objects that are spatially, physically, and optically consistent with the surroundings. With this scalable automatic data generation pipeline, we can create a dataset for learning object insertion, which is used to train our proposed text-conditioned diffusion model. Qualitative and quantitative experiments have shown that our model achieves state-of-the-art results in object insertion, particularly for in-the-wild images. We show compelling results on diverse insertion prompts and images across various domains. In addition, we automate iterative insertion by combining our insertion model with beam search guided by CLIP.

Semantic segmentation is an important task for many applications but it is still quite challenging to achieve advanced performance with limited computational costs. In this paper, we present CGRSeg, an efficient yet competitive segmentation framework based on context-guided spatial feature reconstruction. In it, a Rectangular Self-Calibration Module is carefully designed for spatial feature reconstruction and pyramid context extraction. It captures the global context in both horizontal and vertical directions and gets the axial global context to explicitly model rectangular key areas. A shape self-calibration function is designed to make the key areas more close to the foreground object. Besides, a lightweight Dynamic Prototype Guided head is proposed to improve the classification of foreground objects by explicit class embedding. Our CGRSeg is extensively evaluated on ADE20K, COCO-Stuff, and Pascal Context benchmarks, and achieves state-of-the-art semantic performance. Specifically, it achieves 43.6% mIoU on ADE20K with only 4.0 GFLOPs, which is 0.9% and 2.5% mIoU better than SeaFormer and SegNeXt but with about 38.0% fewer GFLOPs.

Deep neural networks (DNNs) have been widely deployed in real-world, mission-critical applications, necessitating effective approaches to protect deep learning models against malicious attacks. Motivated by the high stealthiness and potential harm of backdoor attacks, a series of backdoor defense methods for DNNs have been proposed. However, most existing approaches require access to clean training data, hindering their practical use. Additionally, state-of-the-art (SOTA) solutions cannot simultaneously enhance model robustness and compactness in a data-free manner, which is crucial in resource-constrained applications. To address these challenges, in this paper, we propose Clean & Compact (C&C), an efficient data-free backdoor defense mechanism that can bring both purification and compactness to the original infected DNNs. Built upon the intriguing rank-level sensitivity to trigger patterns, C&C co-explores and achieves high model cleanliness and efficiency without the need for training data, making this solution very attractive in many real-world, resource-limited scenarios. Extensive evaluations across different settings consistently demonstrate that our proposed approach outperforms SOTA backdoor defense methods.

Utilizing a unified model to detect multi-class anomalies is a promising solution to real-world anomaly detection. Despite their appeal, such models typically suffer from large model parameters and thus pose a challenge to their deployment on memory-constrained embedding devices. To address this challenge, this paper proposes a novel ViT-style multi-class detection approach named MoEAD, which can reduce the model size while simultaneously maintaining its detection performance. Our key insight is that the FFN layers within each stacked block (i.e., transformer blocks in ViT) mainly characterize the unique representations in these blocks, while the remaining components exhibit similar behaviors across different blocks. The finding motivates us to squeeze traditional stacked transformed blocks from N to a single block, and then incorporate Mixture of Experts (MoE) technology to adaptively select the FFN layer from an expert pool in every recursive round. This allows MoEAD to capture anomaly semantics step-by-step like ViT and choose the optimal representations for distinct class anomaly semantics, even though it shares parameters in all blocks with only one. Extensive experiments show that, compared to the state-of-the-art (SOTA) anomaly detection methods, MoEAD achieves a desirable trade-off between performance and memory consumption. It not only employs the smallest model parameters, has the fastest inference speed, but also obtains competitive detection performance.

Knowledge distillation (KD), known for its ability to transfer knowledge from a cumbersome network (teacher) to a lightweight one (student) without altering the architecture, has been garnering increasing attention. Two primary categories emerge within KD methods: feature-based, focusing on intermediate layers' features, and logits-based, targeting the final layer's logits. This paper introduces a novel perspective by leveraging diverse knowledge sources within a unified KD framework. Specifically, we aggregate features from intermediate layers into a comprehensive representation, efficiently capturing essential knowledge without redundancy. Subsequently, we predict the distribution parameters from this representation. These steps transform knowledge from the intermediate layers into corresponding distributive forms, which are then conveyed through a unified distillation framework. Numerous experiments were conducted to validate the effectiveness of the proposed method. Remarkably, the distilled student network not only significantly outperformed its original counterpart but also, in many cases, surpassed the teacher network.

Recently, the transform-based low-rank tensor factorization (t-LRTF) has emerged as a promising tool for multi-dimensional data recovery. However, the discrete transforms along the third (i.e., temporal/spectral) dimension are dominating in existing t-LRTF methods, which hinders their performance in addressing temporal/spectral degeneration scenarios, e.g., video frame interpolation and multispectral image (MSI) spectral super-resolution. To break this barrier, we propose a novel Functional Transform-based Low-Rank Tensor Factorization (FLRTF), where the learnable functional transform is expressed by the implicit neural representation with positional encodings. The continuity brought by this function allows FLRTF to capture the smoothness of data in the third dimension, which will benefit the recovery of temporal/spectral degeneration problems. To examine the effectiveness of FLRTF, we establish a general FLRTF-based multi-dimensional data recovery model. Experimental results, including video frame interpolation/extrapolation, MSI band interpolation, and MSI spectral super-resolution tasks, substantiate that FLRTF has superior performance as compared with representative data recovery methods.

Vision and Language (VL) models have achieved remarkable performance in a variety of multimodal learning tasks. The success of these models is attributed to learning a joint and aligned representation space of visual and text. However, recent popular VL models still struggle with concepts understanding beyond bag-of-objects in images & texts, suffering from compositional reasoning about relationship between objects & attributes and word order. To address the above issues, we create a synthetic multimodal counterfactual dataset (COCO-CF) and propose a novel contrastive learning framework (COMO). We contribute the COCO-CF dataset which is automatically generated from MS-COCO by injecting concepts from off-the-shelf language models and diffusion models to reduce the bias of bag-of-objects. We contribute the COMO framework for effectively leveraging COCO-CF to treat the counterfactual samples as hard negatives and reweight their importance during contrastive learning. Extensive experiments and ablations show COMO achieved a significant improvement of VL concept understanding on the two VL-Checklist and Winoground benchmarks over five strong VL baselines in their zero-shot setting evaluations.

Knowledge distillation is an effective method for training lightweight vision models. However, acquiring teacher supervision for training samples is often costly, especially from large-scale models like vision transformers (ViTs). In this paper, we develop a simple framework to reduce the supervision cost of ViT distillation: masking out a fraction of input tokens given to the teacher. By masking input tokens, one can skip the computations associated with the masked tokens without requiring any change to teacher parameters or architecture. We find that masking patches with the lowest student attention scores is highly effective, saving up to 50% of teacher FLOPs without any drop in student accuracy, while other masking criterion leads to suboptimal efficiency gains. Through in-depth analyses, we reveal that the student-guided masking provides a good curriculum to the student, making teacher supervision easier to follow during the early stage and challenging in the later stage.

This paper presents a novel approach for real-time image editing leveraging few-shot diffusion models. We demonstrate that disentangled controls can be easily achieved in the few-shot diffusion model by conditioning on a detailed text prompt. Our method involves generating a source image by fixing the random seed and utilizing a lengthy text prompt, followed by modifying one attribute in the text prompt to regenerate the target image. We observe that the source and target images are nearly identical, differing only in the modified attribute. Additionally, we introduce an iterative image inversion technique. The inversion network is conditioned on the input image and the reconstructed image from the previous step, allowing for the correction of the reconstructed image towards the input image. The information of the input image is preserved in the detailed text prompt and four levels of noise maps. To manipulate the inverted image, we freeze the noise maps and modify one attribute in the text prompt, resulting in the generation of a new image similar to the input image with only one attribute changed. Furthermore, our method achieves real-time performance, running in milliseconds for both the inversion and editing processes.

In black-box attacks based on substitute training, the similarity of the substitute model to the target model is critical for successful attacks. However, existing schemes merely train the substitute model to mimic the outputs of the target model without fully simulating the decision space, resulting in the adversarial samples generated by the substitute model being classified into the non-target class by the target model. To alleviate this issue, we propose a novel Inter-Class Topology Alignment (ICTA) scheme to more comprehensively simulate the target model by aligning the inter-class positional relationships of two models in the decision space. Specifically, we first design the Position Exploration Sample (PES) to more thoroughly explore the relative positional relationships between classes in the decision space of the target model. Subsequently, we align the inter-class topology between the two models by utilizing the PES to constrain the inter-class relative position of the substitute model in different directions. In this way, the substitute model is more consistent with the target model in the decision space, so that the generated adversarial samples will be more successful in misleading the target model to classify them into the target class. The experimental results demonstrate that our ICTA significantly improves attack success rate in various scenarios compared to existing substitute training methods, particularly performing efficiently in target attacks.

Vision-language (VL) models have shown to be very effective in a variety of object detection tasks by utilizing weakly supervised image-text pairs from the web. However, these models exhibit a limited understanding of complex compositions of visual objects (e.g., attributes, shapes, and their relations), resulting in a significant performance drop given complex and diverse language queries. While conventional methods try to enhance VL models through the use of hard negative synthetic augmentation on the text domain, their effectiveness remains restricted without densely paired image-text augmentation. In this paper, we introduce a structured synthetic data generation approach to improve the compositional understanding of VL models for language-based object detection, which generates densely paired positive and negative triplets (object, text descriptions, bounding boxes) in both image and text domains. In addition, in order to train VL models effectively, we propose a new compositional contrastive learning formulation that discovers semantics and structures in complex descriptions from synthetic triplets. As a result, VL models trained with our synthetic data generation exhibit a significant performance boost in the Omnilabel benchmark by up to +5AP and the D3 benchmark by +6.9AP upon existing baselines.

The binary cross-entropy (BCE) loss function is widely utilized in multi-label classification (MLC) tasks, treating each label independently. The log-sum-exp pairwise (LSEP) loss, which emphasizes higher logits for positive classes over negative ones within a sample and accounts for label dependencies, has demonstrated effectiveness for MLC. However, our experiments suggest that its performance in long-tailed multi-label classification (LTMLC) appears to be inferior to that of BCE. In this study, we investigate the impact of the log-sum-exp operation on recognition and explore optimization avenues. Our observations reveal two primary shortcomings of LSEP that lead to its poor performance in LTMLC: 1) the indiscriminate use of label dependencies without consideration of the distribution shift between training and test sets, and 2) the overconfidence in negative labels with features similar to those of positive labels. To mitigate these problems, we propose a distributionally robust loss (DR), which includes class-wise LSEP and a negative gradient constraint. Additionally, our findings indicate that the BCE-based loss is somewhat complementary to the LSEP-based loss, offering enhanced performance upon integration. Extensive experiments conducted on two LTMLC datasets, VOC-LT and COCO-LT, demonstrate the consistent effectiveness of our proposed method. The code will be made publicly available shortly.

In the e-commerce realm, compelling advertising images are pivotal for attracting customer attention. While generative models automate image generation, they often produce substandard images that may mislead customers and require significant labor costs to inspect. This paper delves into increasing the rate of available generated images. We first introduce a multi-modal Reliable Feedback Network (RFNet) to automatically inspect the generated images. Combining the RFNet into a recurrent process, Recurrent Generation, results in a higher number of available advertising images. To further enhance production efficiency, we fine-tune diffusion models with an innovative Consistent Condition regularization utilizing the feedback from RFNet (RFFT). This results in a remarkable increase in the available rate of generated images, reducing the number of attempts in Recurrent Generation, and providing a highly efficient production process without sacrificing visual appeal. We also construct a Reliable Feedback 1 Million (RF1M) dataset which comprises over one million generated advertising images annotated by humans, which helps to train RFNet to accurately assess the availability of generated images and faithfully reflect the human feedback. Generally speaking, our approach offers a reliable solution for advertising image generation. The dataset and code will be released after acceptance.

Recent studies have demonstrated the effectiveness of token-based methods for visual content generation. As a representative work, non-autoregressive Transformers (NATs) are able to synthesize images with decent quality in a small number of steps. However, NATs usually necessitate configuring a complicated generation policy comprising multiple manually-designed scheduling rules. These heuristic-driven rules are prone to sub-optimality and come with the requirements of expert knowledge and labor-intensive efforts. Moreover, their one-size-fits-all nature cannot flexibly adapt to the diversified characteristics of each individual sample. To address these issues, we propose AdaNAT, a learnable approach that automatically configures a suitable policy tailored for every sample to be generated. In specific, we formulate the determination of generation policies as a Markov decision process. Under this framework, a lightweight policy network for generation can be learned via reinforcement learning. Importantly, we demonstrate that simple reward designs such as FID or pre-trained reward models, may not reliably guarantee the desired quality or diversity of generated samples. Therefore, we propose an adversarial reward design to guide the training of policy networks effectively. Comprehensive experiments on four benchmark datasets, i.e., ImageNet-256 & 512, MS-COCO, and CC3M, validate the effectiveness of AdaNAT. All the code and models will be released after acceptance.

Polygonal mesh reconstruction of a raw point cloud is a valuable topic in the field of computer graphics and 3D vision. Especially to 3D architectural models, polygonal mesh provides concise expressions for fundamental geometric structures while effectively reducing data volume. However, there have some limitations of traditional reconstruction methods: normal vector dependency, noisy points and defective parts sensitivity, and internal geometric structure lost, which reduce the practicality in real scene. In this paper, we propose a robust and efficient polygonal mesh reconstruction method to address the issues in architectural point cloud reconstruction task. It is an iterative adaptation process to detect planar shapes from scattered points. The initial structural polygonal mesh can be established in the constructed convex polyhedral space without assistance of normal vectors. Then, we develop an efficient polygon-based winding number strategy to orient polygonal mesh with global consistency. The significant advantage of our method is to provide a structural reconstruction for architectural point clouds and avoid point-based normal vector analysis. It effectively improves the robustness to noisy points and defective parts. More geometric details can be preserved in the reconstructed polygonal mesh. Experimental results show that our method can reconstruct concise, oriented and faithfully polygonal mesh that are better than results of state-of-the-art methods.

We present a novel pipeline for learning triangular human avatars from multi-view videos. Recent methods for avatar learning are typically based on neural radiance fields (NeRF), which is not compatible with traditional graphics pipeline and poses great challenges for operations like editing or synthesizing under different environments. To overcome these limitations, our method represents the avatar with an explicit triangular mesh extracted from an implicit SDF field, complemented by an implicit material field conditioned on given poses. Leveraging this triangular avatar representation, we incorporate physics-based rendering to accurately decompose geometry and material. To enhance both the geometric and appearance details, we further employ a 2D UNet as the network backbone and introduce pseudo normal ground-truth as additional supervision. Experiments show that our method can learn triangular avatars with high-quality geometry reconstruction and material decomposition, inherently supporting editing, manipulation or relighting operations.

Scene representations using 3D Gaussian primitives have produced excellent results in modeling the appearance of static and dynamic 3D scenes. Many graphics applications, however, demand the ability to manipulate both the appearance and the physical properties of objects. We introduce Feature Splatting, an approach that unifies physics-based dynamic scene synthesis with rich semantics from vision language foundation models that are grounded by natural language. Our first contribution is a way to distill high-quality, object-centric vision-language features into 3D Gaussians, that enables semi-automatic scene decomposition using text queries. Our second contribution is a way to synthesize physics-based dynamics from an otherwise static scene using a particle-based simulator, in which material properties are assigned automatically via text queries. We ablate key techniques used in this pipeline, to illustrate the challenge and opportunities in using feature-carrying 3D Gaussians as a unified format for appearance, geometry, material properties and semantics grounded on natural language.

Label dependencies have been widely studied in multi-label image recognition for improving performances. Previous methods mainly considered label co-occurrences as label correlations. In this paper, we show that label co-occurrences may be insufficient to represent label correlations, and modeling label correlations relies on latent context information. To this end, we propose a latent context embedding information network for multi-label image recognition. Our proposal is straightforward and contains three key modules to correspondingly tackle three questions, \ie, where to locate the latent context information, how to utilize the latent context information, and how to model label correlations with context-aware features. First, the multi-level context feature fusion module fuses the multi-level feature pyramids to obtain sufficient latent context information. Second, the latent context information embedding module aggregates the latent context information into categorical features, and thus the label correlation can be directly established. Moreover, we use the label correlation capturing module to model label correlations with full and partial manners, respectively. Comprehensive experiments validate the correctness of our arguments and the effectiveness of our method. In both generic multi-label classification and partial-label multi-label classification, our proposed method consistently achieves promising results.

Moving object segmentation in the presence of atmospheric turbulence is highly challenging due to turbulence-induced irregular and time-varying distortions. In this paper, we present an unsupervised approach for segmenting moving objects in videos downgraded by atmospheric turbulence. Our key approach is to adopt a detect-then-grow scheme: we first identify a small set of pixels that belong to moving objects with high confidence, then gradually grow a foreground mask from those seeds that segment all moving objects in the scene. In order to disentangle different types of motions, we check the rigid geometric consistency among video frames. We then use the Sampson distance to initialize the seedling pixels. After growing per-frame foreground masks, we use spatial grouping loss and temporal consistency loss to further refine the masks in order to ensure their spatio-temporal consistency. Our method is unsupervised and does not require training on labeled data. For validation, we collect and release the first real-captured long-range turbulent video dataset with ground truth masks for moving objects. We evaluate our method both qualitatively and quantitatively on our real dataset. Results show that our method achieves good accuracy in segmenting moving objects and is robust for long-range videos with various turbulence strengths.

Image super-resolution (SR) is a critical technique for enhancing image quality, playing a vital role in image enhancement. While recent advancements, notably transformer-based methods, have advanced the field, infrared image SR remains a formidable challenge. Due to the inherent characteristics of infrared sensors, such as limited resolution, temperature sensitivity, high noise levels, and environmental impacts, existing deep learning methods result in suboptimal enhancement outcomes when applied to infrared images. To address these challenges, we propose a specialized Contourlet residual framework tailored for infrared images to restore and enhance the critical details from the multi-scale and multi-directional infrared spectra decomposition. It precisely captures and amplifies the high-pass subbands of infrared images, such as edge details and texture nuances, which are vital for achieving superior reconstruction quality. Moreover, recognizing the limitations of traditional learning techniques in capturing the inherent characteristics of infrared images, we incorporate a prompt-based learning paradigm. This approach facilitates a more nuanced understanding and targeted optimization process for infrared images by leveraging the semantic comprehension offered by the visual language model. Our approach not only addresses the common pitfalls associated with infrared imaging but also sets a new paradigm for infrared image SR. Extensive experiments demonstrate that our approach obtains superior results against the existing visible image SR models, attaining state-of-the-art performance.
